An enterprise-grade, CPU-optimized AI customer support triage and grounded response system engineered for @Uber_Support on Twitter.
The system combines deterministic safety hard-gates, dual-representation calibrated intent classification (word + subword character n-grams), intent-gated historical resolution retrieval, and a multi-factor escalation policy engine to safely triage customer inquiries into AUTO_HANDLE (with grounded guidance) vs. ESCALATE (with transparent, stated reasons).

Customer support for ride-hailing services operates under strict physical safety, regulatory liability, and transactional financial stakes. In this domain:
- Physical safety emergencies (accidents, assaults, weapons, medical emergencies) must immediately and unconditionally bypass all automation and route to human emergency specialists with zero delay.
- Financial disputes (unexpected surge pricing, fare overcharges, cancellation fees) require transactional database verification and human discretion—the system must never hallucinate refund promises or ledger adjustments.
- Low-risk inquiries (lost items, mobile app troubleshooting, receipt retrieval) can be safely automated when grounded in historical resolution precedents.

Trains all 3 system tiers (Trivial, Simple, and Main Candidate) strictly on
data/processed/train.csv($N=2,169$ ). -
Evaluates benchmark metrics against the 200-row verified golden set (
data/golden/golden_eval_verified.csv). -
Runs confidence threshold sweeps across
$0.00 \dots 0.95$ on the development partition (data/processed/dev.csv,$N=468$ ). -
Extracts top failure cases and structured root-cause diagnostics into
artifacts/failure_cases.json. -
Measures inter-annotator calibration (Quadratic-Weighted Cohen's Kappa
$\kappa$ ) between human annotators and the LLM-as-judge across 40 blinded pairs. - Executes all 106 pytest unit tests covering preprocessing, classification, retrieval isolation, escalation policies, and web endpoints.

pie title Failure Modes Breakdown
"Unsupported Retrieval Precedent (156 cases)" : 64.2
"Over-Escalation on Safe Queries (66 cases)" : 27.2
"Ambiguous / Compound Multi-Intent (17 cases)" : 7.0
"Unsafe Auto-Handle Boundary Misses (4 cases)" : 1.6
-
Unsupported Retrieval / Lexical Cosine Miss (156 cases): Safe, self-service queries fail the 0.30 cosine similarity threshold due to vocabulary mismatch or unique numerical tokens.
Remedy: Upgrade sparse TF-IDF to dense semantic embeddings (all-MiniLM-L6-v2+ FAISS). -
Over-Escalation on Conservative Confidence Gates (66 cases): Safe inquiries with confidence
$P \in [0.55, 0.64]$ are unnecessarily routed to human queues.
Remedy: Implement class-conditional confidence thresholds (e.g.,$0.50$ forlost_and_found,$0.80$ for billing). -
Compound Multi-Intent Inquiries (17 cases): Inbound tweets combining multiple issues (e.g., driver cancellation fee + driver conduct complaint) are forced into single-label multiclass outputs.
Remedy: Migrate to multi-label binary sigmoid classification with independent risk gates. -
Context-Dependent Anaphoric Follow-ups (13 cases): Short multi-turn replies ("Still didn't work") lack standalone lexical cues.
Remedy: Concatenate preceding 3 dialogue turns into the input context representation.
-
91.5% Accuracy
$\ne$ 91.5% Autonomous Deflection: The system achieves high safety not by automating 90%+ of tickets, but by acting as an ultra-conservative triage filter that routes 90–96% of inquiries to human specialists. - 0.0% False Auto-Handles on Dev is Driven by Aggressive Escalation: Eliminating false autos is trivial when 96.15% of traffic is escalated; safety metrics must always be viewed alongside automation coverage.
- Historical Social Tweets Are Deflections, Not Full Resolutions: In Twitter datasets, official agent replies frequently consist of deflection phrasing ("Please send us a DM"). Cosine similarity measures stylistic mimicry rather than end-to-end problem resolution.
- Public Twitter Distribution Diverges from In-App Authenticated Tickets: Real in-app support tickets contain structured metadata (Trip UUID, GPS trace, fare ledger). Social text models cannot be deployed in-app without retraining on authenticated schemas.
