An advanced stratified stacking ensemble deep learning architecture that reconstructs 15 discrete layers of 3D subsurface ocean temperature from 2D satellite-derived surface observations. By combining two distinct physics-informed base models—integrating the spatial feature extraction of Swin Transformer V2, the global spectral modeling of a Fourier Neural Operator (FNO), alongside Graph Neural Networks (GNN), CBAM Attention, and Latent Temporal Modules—OceanEmbed delivers state-of-the-art subsurface predictions alongside an interactive WebGL-powered geospatial visualization platform.

Ocean dynamics are chaotic and computationally expensive to simulate numerically. OceanEmbed bridges the gap between observable surface conditions and internal physical states by learning a direct mapping to the 3D subsurface temperature structure via a robust meta-learner ensemble.
To guarantee operational speed and low-latency rendering for the digital twin, the system is deployed using a high-performance, dual-backend architecture:
- Machine Learning Backend (Python): Handles heavy tensor computations, with the ensemble models serialized and exported via TorchScript for optimized, graph-compiled inference.
- Application Backend (Node.js): A lightweight, highly concurrent server designed for maximum speed, orchestrating data flow to the frontend UI.
- Low-Latency Caching (Redis): In-memory data grid caching high-frequency spatial queries to prevent redundant model executions.
- Hardware Acceleration: Native deployment support for both CUDA (for GPU-accelerated massive batch processing) and Intel OpenVINO (for optimized, high-throughput CPU inference at the edge).

Progressively reconstructs spatial resolution via bilinear upsampling and 1×1 convolutions, fusing the FNO's physical insights with the spatial clarity of the Swin-V2 skip connections to output a [B, 15, H, W] tensor.
Evaluated against GLORYS12V1 reanalysis ground truth across complex Indian Ocean regions (equatorial currents, Bay of Bengal upwelling, mesoscale eddies).

Huber loss provides robust optimization by acting quadratically for small errors and linearly for large errors. This prevents extreme thermal anomalies or reanalysis outliers from destabilizing the ensemble's gradient updates.
