Architecture Specification: Arc-Native Hybrid Computer Use Agent (CUA)

1. System Overview

The ARC is an asymmetric, dual-tier autonomous agent runtime. It addresses the latency and cost bottlenecks of visual foundation models through two collaborating execution loops:

  1. The Reflex Loop (In-VM, Sub-Millisecond): Operates entirely within the local execution environment (Arc Firecracker MicroVM). It consumes structured accessibility and DOM representations, consults an invariant selector cache, and relies on an in-VM quantized small language/multimodal model (e.g., Qwen2-VL-2B or UI-TARS-2B) to execute routine single-hop actions.
  2. The Cortex Loop (Cloud Escalation, Event-Driven): An escalation tier triggered only when local monitors detect trajectory anomalies (repetitive loops, stalled progress, locator exceptions, or low grounding confidence). It invokes a frontier reasoning model (e.g. Jev / Claude 3.5 Sonnet) with multi-modal context to perform root-cause diagnosis, re-plan the global trajectory, and decompile the solution into a sequence of deterministic sub-goals for the Reflex loop.

2. Perception Subsystem

2.1 Zero-Copy Accessibility Tree Extraction (Web)

Traditional web agents inject heavy JavaScript scripts to serialize the DOM into HTML strings or capture raster screenshots. The ARC interfaces directly with the browser engine process via the Chrome DevTools Protocol (CDP) over a local Unix Domain Socket (/tmp/chromium-cdp.sock):

  • Calls Accessibility.getFullAXTree.
  • Runs a C++/Rust native sanitizer to prune redundant nodes:
    • Discards unlabelled containers (div, span lacking click handlers, ARIA labels, or text nodes).
    • Eliminates hidden subtrees (aria-hidden="true", display: none, visibility: hidden).
    • Assigns unique, monotonic numerical indices to every actionable element: [#12] Button 'Submit Order'.
  • Output representation: YAML-style linearized string consuming $\le 1,200$ tokens for standard complex web pages (an 84% reduction compared to raw HTML).
    • The budget is enforced, not merely targeted: when a page exceeds it, nodes are evicted by role tier — high-volume data rows and cells first, interactive affordances last, and dialog/menu/listbox/tablist (plus their ancestors) never — so an open modal is not lost to a dense data table.
    • Every eviction is announced in-band: truncation_notice names the evicted roles and the specific dropped [#N] affordances, and dropped_actionable_count / dropped_node_count quantify them. truncated: true means perception is incomplete — re-inspect, narrow the scope, or escalate to visual perception (§2.3).
    • Per-glyph text coalescing. Chromium emits one StaticText node per glyph on pages laid out with per-character boxes — example.com produced 785 text nodes of which 763 were single characters, so the budget was spent one letter per line. Adjacent childless, non-actionable StaticText/InlineTextBox siblings are merged into a single node (_coalesce_text_runs), and text-role names are kept verbatim because the separator spaces are part of them (' النطاق'). example.com fell from ~1,097 truncated tokens to 291 and stopped truncating; sentence order is correct in RTL and CJK.

2.2 Linux Desktop AT-SPI D-Bus Daemon

For operating system tasks (OSWorld), the agent attaches to the Linux accessibility bus (org.a11y.Bus):

  • Recursively queries org.a11y.atspi.Accessible interfaces across GTK, Qt, and Electron processes.
  • Subscribes to D-Bus signal streams:
    • window:activate
    • object:state-changed (focused, selected, expanded)
    • object:text-changed
  • Correlates screen coordinates with application window bounds directly from X11 (_NET_ACTIVE_WINDOW), ensuring the tree remains synchronized without visual diffing.

2.3 Visual Fallback Trigger (Local OmniParser)

When an interaction targets HTML5 <canvas> (e.g. Figma, Google Docs) or unannotated WebGL/video components, the AXTree yields empty nodes.

  • A local visual fallback daemon executes:
    • Grabs an in-memory frame buffer screenshot via /dev/shm/xwd or CDP Page.captureScreenshot.
    • Runs INT8 ONNX-quantized OmniParser (YOLOv8 icon detection + PaddleOCR/TrOCR) on the VM's local CPU/vGPU.
    • Generates Set-of-Mark bounding boxes locally ($&lt;45,\text{ms}$).
    • If detector confidence falls below $\tau = 0.70$, routes immediately to the Cortex Engine.

3. The Reflex Engine

3.1 Sub-Goal Playwright Compiler

Actions are emitted as structured symbolic tuples: $$\text{Action} = \langle \text{Verb}, \text{TargetLocator}, \text{Parameters} \rangle$$ Verbs include:

  • CLICK: Dispatches mouse-down, click, mouse-up sequence with natural Bézier motion.
  • TYPE: Dispatches keyboard key-down, char input, key-up with humanized jitter ($20-50,\text{ms}$).
  • SELECT: Direct DOM option mutation.
  • SCROLL: Delta scroll event along the vertical or horizontal axis.

3.2 Invariant Selector Cache & Self-Healing

To eliminate redundant inference calls across recurring workflows:

  • The cache stores an LRU mapping of (GoalHash, ContextHash) -> SelectorTuple.
  • SelectorTuple includes:
    1. Primary: Semantic test attribute (data-testid, id).
    2. Secondary: ARIA role and normalized accessible name (button[name='Checkout']).
    3. Tertiary: Anchored structural XPath.
  • Self-Healing: If the primary selector fails due to dynamic class name mutation, the engine computes normalized Levenshtein string distance against visible AXNode labels, automatically repairing the locator without cloud intervention.

4. Cascading Gatekeepers & Anomaly Detection

4.1 ModernBERT Stuck Monitor

To identify infinite loops or dead ends:

  • Computes a 64-bit SimHash of the current cleaned accessibility tree: $H(s_t)$.
  • Compares consecutive states:
    • If $H(s_t) == H(s_{t-1})$ after an action expected to trigger navigation $\implies$ potential zero-pixel trap or unhandled click.
    • If $H(s_t) == H(s_{t-2})$ and $a_t == a_{t-2} \implies$ cyclic oscillation.
  • A fine-tuned ModernBERT-base sequence classifier inspects the sliding history window: $$\tau_{t-4:t} = {(s_{t-4}, a_{t-4}), \dots, (s_t, a_t)}$$ Predicts the stuck probability $P(\text{stuck})$. If $P(\text{stuck}) &gt; \alpha_{\text{escalate}}$ for $N=2$ consecutive ticks, triggers Cortex escalation.

4.2 Semantic Milestone Monitor

  • Computes the semantic progress delta: $$\text{Progress}(g, s_t, s_0) = \cos(\mathbf{e}g, \mathbf{e}{s_t} - \mathbf{e}_{s_0})$$ using an in-VM embedding model (bge-micro-v2).
  • If progress stalls across $N \ge 3$ consecutive steps or diverges from the high-level intent vector $g$, an anomaly interrupt is dispatched.

4.3 Asymmetric Cooldown & Hysteresis Dampening

Prevents high-frequency oscillation between Reflex and Cortex:

  • Once Cortex returns a recovery plan, Reflex enters a cooldown lock for $M=3$ local steps.
  • During cooldown, transient rendering delays or micro-stalls do not trigger Cortex escalation, unless an unrecoverable exception (process crash, page 404, locator not found) occurs.

4.4 Deterministic Sliding-Window Stuck Monitor (Phase 3A)

To guarantee zero-network, sub-millisecond anomaly detection, Phase 3A introduces the deterministic StuckMonitor. Operating across a sliding window of the last $k=5$ steps, it evaluates 7 distinct failure patterns:

  1. Repeated Action with No State Change: Dispatches of identical (verb, target) producing zero state delta ($H(s_t) == H(s_{t-1})$).
  2. Same Locator Failing Multiple Times: Repeated execution exceptions or locator resolution failures on the same selector ($\ge 2$ occurrences).
  3. Cyclic State Oscillation: Alternating state hash sequences ($H(s_t) == H(s_{t-2})$ and $H(s_{t-1}) == H(s_{t-3})$ where $H(s_t) \neq H(s_{t-1})$) indicating ping-pong trap loops.
  4. Repeated Readiness Timeouts: Session guard readiness checks failing consecutively.
  5. Repeated Action Exceptions: Unhandled Playwright action dispatch errors.
  6. Mechanical Success but Zero State Delta: Action returns success=True on non-neutral verbs, but Hamming distance bit divergence is 0 and URL is unchanged.
  7. Three Consecutive STATE_NOT_CHANGED: Consecutive non-progressing transitions triggering threshold score 1.0.

Evaluates in $&lt;0.01,\text{ms}$ ($p_{95} = 0.0058,\text{ms}$ empirical, well under the $10,\text{ms}$ budget), with zero screenshot dependencies.

4.5 Heuristic Milestone Monitor (Phase 3A)

Detects positive forward progress towards task objectives using fast local heuristics:

  1. Declared State Change Verified: Verified occurrence of an expected state transition.
  2. Target URL Reached: Transitions to an expected URL destination or pathname.
  3. Visible Text Appearance: Verified emergence of specified goal text in post-action state.
  4. Successful Form Submission: State advancement following submit/confirmation clicks.
  5. State Advance with Positive Hamming Distance: Structural divergence without error indicators.

Error Invariant: Strictly does NOT trigger on any action resulting in an exception, timeout, or error.
Architecture: Modularized with a pluggable SemanticProgressEstimator interface, enabling drop-in upgrade to in-VM embedding models in Phase 3B.

4.6 Escalation Controller Policy (Phase 3A)

Governs state transitions across four outcomes: CONTINUE, RECOVER_LOCALLY, ESCALATE, and ABORT.

  • Noise Filtering: Single noisy failures or isolated high stuck scores NEVER trigger escalation immediately ($\ge 2$ consecutive stuck evaluations required).
  • Hard Failure Immediate Escalation: Critical faults (locator resolution exhaustion after full fallback chain, page/process crashes, disconnected browser, or explicit ESCALATE actions) bypass consecutive stuck checks and escalate immediately.
  • Post-Recovery Cooldown: Enforces an asymmetric cooldown of $M=3$ local Reflex steps after any recovery execution, suppressing noise during async render cycles.
  • Strict Budget Envelopes: Enforces per-task limits ($3$ escalations maximum, $2$ local recovery attempts). Aborts deterministically if budgets are exceeded.

5. Cortex Escalation Protocol & Sub-Goal Decompilation

When escalation triggers:

  1. Payload Assembly:
    • High-level task objective $g$.
    • History of executed actions and observed state hashes $\tau_{0:t}$.
    • Pruned accessibility tree + compressed screenshot with Set-of-Mark annotations.
    • Detected failure signature (CYCLIC_LOOP, CANVAS_OCCLUSION, LOCATOR_NOT_FOUND, SEMANTIC_DRIFT).
  2. Frontier Inference:
    • Sent via high-speed gRPC streaming to the frontier model (Jev / Claude 3.5 Sonnet).
    • Prompt format enforces a structured JSON recovery schema containing root cause analysis and a linear array of sub-goals.
  3. Plan Decompilation:
    • Cortex response is converted into Reflex DSL commands:
      [
        {"action": "CLICK", "target": "#close-modal-btn"},
        {"action": "TYPE", "target": "#search-input", "value": "2026 Financial Report"},
        {"action": "PRESS_KEY", "key": "Enter"}
      ]
    • Injected into the Reflex FIFO queue; local execution resumes instantly.

5.4 Mock vs Real Cortex Escalation Policy

By default, the runtime operates in deterministic mock mode (CORTEX_MODE=mock):

  • Mock Cortex: Operates entirely offline with zero network connectivity and zero token costs. Evaluates failure context deterministically and synthesizes typed RecoveryPlan objects tailored to LOCATOR_NOT_FOUND, STATE_NOT_CHANGED, ACTION_TIMEOUT, READINESS_TIMEOUT, and ESCALATION_REQUIRED.
  • Real Cortex (Opt-In Only): Enabled exclusively when CORTEX_MODE=real and CORTEX_API_KEY are explicitly configured in the environment. Dispatches full EscalationPayload to frontier LLM APIs. If unconfigured, the system reports REAL_CORTEX_SMOKE_TEST_SKIPPED without halting mock test validation.

5.5 Recovery Compiler Validation & Safety Invariants

The RecoveryCompiler validates and compiles CortexResponse and RecoveryPlan into executable ActionStep sequences:

  • Allowed Verbs: Restricts execution strictly to 11 verified verbs (CLICK, TYPE, SELECT, SCROLL, PRESS_KEY, GOTO, WAIT, ASSERT_VISIBLE, ASSERT_TEXT, NOOP, ESCALATE).
  • Target Enforcements: Verbs requiring DOM interaction (CLICK, TYPE, SELECT, ASSERT_VISIBLE, ASSERT_TEXT) MUST specify a valid target selector or index.
  • Safety Constraints: Rejects dangerous schemes (javascript:, file:, data:) in GOTO actions, and caps wait durations ($\le 60,000,\text{ms}$).
  • Recovery Metadata: Injects plan_id, plan_source, and recovery telemetry flags into each compiled step.

5.6 Hybrid Runner Execution Flow

receive action sequence
    -> dispatch step via ReflexRunner
-> update telemetry & state verifier
    -> evaluate StuckMonitor (sliding window)
    -> evaluate MilestoneMonitor (progress heuristics)
    -> EscalationController decision:
-> CONTINUE -> advance to next scheduled step
-> RECOVER_LOCALLY -> dispatch local settling step, activate cooldown
-> ESCALATE -> build EscalationPayload -> query Cortex -> compile plan -> execute recovery -> activate cooldown
-> ABORT -> halt execution, record abort reason
    -> emit final HybridRunResult

5.7 Phase 3B: Production Escalation Layer & Learned Monitor Path

Phase 3B upgrades the escalation tier from purely deterministic local mock models to an extensible, production-grade escalation framework while preserving offline determinism as the default.

5.7.1 Trajectory Dataset Collection & Sliding Windows

The TrajectoryCollector captures structured trajectory records across each step:

  • Standard Schema: run_id, task_id, step_id, timestamp, action_type, target_locator, locator_strategy, readiness_passed, execution_success, state_hash_before, state_hash_after, state_changed, hamming_distance, url_before, url_after, url_changed, error_detected, error_type, monitor_stuck_score, monitor_milestone_score, escalation_decision, recovery_attempted, recovery_success, and integration_mode.
  • Sliding Windowing: Collects the current step along with a sliding window of the last 5 steps (TrajectoryWindow).
  • Strict Credential Redaction: Automatically scrubs authentication tokens, passwords, bearer headers, and API keys matching security patterns before JSONL persistence (artifacts/phase3b/trajectory_logs/).

5.7.2 Deterministic Auto-Labeling Pipeline

The AutoLabeler annotates trajectory windows offline without requiring external model queries:

  • Stuck Heuristics:
    1. Three consecutive no-state-change actions ($\text{Hamming}=0$ and $\text{URL unchanged}$).
    2. Same target locator failing $\ge 2$ times.
    3. Cyclic state hash oscillation ($H(s_t) == H(s_{t-2})$ and $H(s_t) \neq H(s_{t-1})$).
    4. Repeated readiness timeouts ($\ge 2$).
    5. Repeated action execution exceptions ($\ge 2$).
  • Milestone Heuristics:
    1. Explicit declared state change verified.
    2. Navigation reached target URL destination.
    3. Expected visible text appeared in post-state.
    4. Clean state transition ($\text{Hamming}&gt;0$, no error detected).
  • Artifacts: Emits stuck.jsonl, milestone.jsonl, and summary.json into artifacts/phase3b/labeled/.

5.7.3 Monitor Model Interface & Heuristic Adapters

Abstracts monitor predictions into a standardized pluggable contract:

  • MonitorModel: Abstract interface with predict(window: MonitorWindow) -> MonitorPrediction.
  • MonitorPrediction: Normalized container providing score: float, reason: str, evidence: dict, model_name: str, is_positive: bool, and confidence: float.
  • Heuristic Adapters: HeuristicStuckModelAdapter and HeuristicMilestoneModelAdapter wrap deterministic Phase 3A monitors into the pluggable interface with zero added overhead ($p_{95} \le 0.06,\text{ms}$).

5.7.4 Feature Builder

The FeatureBuilder extracts 16 deterministic, JSON-serializable features from any trajectory window in $&lt;0.03,\text{ms}$ ($p_{95}=0.025,\text{ms}$):

  • Window metrics: window_size, action_repeat_count, locator_repeat_count, locator_failure_count, readiness_timeout_count, action_exception_count, consecutive_no_state_change.
  • State & Distance sequences: hamming_distance_sequence, state_hash_cycle_detected, url_changed, error_detected, expected_state_change_verified, visible_text_delta.
  • Semantic Sequences: action_type_sequence, target_role_sequence, target_name_sequence.

5.7.5 Optional Learned Monitor & Silent Fallback Policy

To ensure tests run fast and hermetically on any environment without GPU/PyTorch/Transformers:

  • TransformerMonitorAdapter supports loading small local encoders (ModernBERT-base, DeBERTa-v3-small, distilbert-base-uncased) from a local filesystem path only.
  • If dependencies (torch, transformers) are absent, it returns LEARNED_MONITOR_UNAVAILABLE safely without raising exceptions or making remote downloads.
  • Training script scripts/training/train_monitors.py detects dependency availability; if missing, it writes artifacts/phase3b/models/TRAINING_SKIPPED.md and exits cleanly.

5.7.6 Pluggable Semantic Progress Estimator

  • SemanticProgressEstimator: Base interface supporting both full trajectory windows and state text diffs.
  • HeuristicProgressEstimator: Default offline token-overlap progression estimator.
  • EmbeddingProgressEstimator: Pluggable dense embedding estimator with automatic, silent fallback to heuristic if sentence-transformers/models are missing.

5.7.7 Real & Dry-Run Cortex HTTP Adapter

HttpCortexClient replaces static stubs with a production HTTP client:

  • Modes:
    • mock: Pure deterministic offline recovery (default).
    • dry_run: Constructs complete diagnostic payload (task goal, escalation reason, trajectory window, state hashes, locator attempts, errors, and budget) without dispatching network calls.
    • real: Dispatches HTTP POST with exponential backoff (max 3 retries), safe timeouts (CORTEX_TIMEOUT_MS), and schema validation.
  • Compilation & Safety Invariant: All responses MUST validate through RecoveryCompiler. API keys and credentials are never logged.

5.7.8 Live Browser Hybrid Smoke Testing

  • tests/test_hybrid_live.py and scripts/tools/smoke_phase3b.py execute end-to-end against real headless Chromium.
  • Validates typing, intentional stalling (repeated no-op actions), stuck detection, escalation to mock Cortex, recovery compilation, recovery execution in DOM, and telemetry persistence.
  • If Chromium binary is missing, gracefully records LIVE_BROWSER_SMOKE_SKIPPED.

6. Arc MicroVM Lifecycle & Snapshotting

Built on Firecracker lightweight virtualization:

  • MicroVM Startup: Replaced with UFFD (Userfaultfd) memory snapshots.
  • State Forking: Before attempting risky actions (e.g. submitting a form, executing shell scripts, destructive deletions), the agent takes a sub-5ms memory-COW snapshot.
  • If the Stuck Monitor triggers or an irrecoverable error occurs, the VM state can be rolled back to the pre-action snapshot in $&lt;5,\text{ms}$, allowing speculative alternative paths without permanent environment corruption.

7. Phase 4A: Evaluation & Benchmarking Subsystem

Phase 4A introduces an offline, reproducible local evaluation harness, synthetic task suite, success assertion engine, cost ledger, and scorecard report generator prior to external WebArena / OSWorld integration.

7.1 Evaluation Schemas & Contracts

  • EvalTask: Complete task specification including task_id, category, start_url, typed action_steps (ActionStep), expected_assertions (EvalAssertion), step bounds (max_steps), and recovery metadata.
  • EvalAssertion & EvalAssertionResult: Declarative state verification contract supporting 6 assertion modalities:
    1. url: Substring or regex match against page.url.
    2. visible_text: Text visibility check with Zero-Pixel Trap validation.
    3. element_state: Interactive/DOM state validation (visible, hidden, attached, detached, enabled, disabled, checked).
    4. input_value: Value verification on inputs/textareas.
    5. page_title: Page title string matching.
    6. state_hash_changed: Bitwise Hamming distance verification via compute_hamming_distance integrating with StateVerifier.
  • EvalResult: Task execution outcome detailing steps, reflex share, escalations, recoveries attempted/succeeded, milestone detections, durations, costs, and individual assertion results.
  • CostRecord: Task-level accounting record for reflex compute, mock/real cortex tokens, and infrastructure runtimes.
  • ScorecardSummary & EvalRunSummary: Aggregated run-level scorecard reporting success rates, latency percentiles ($p_{50}, p_{95}, p_{99}$), and comparative deltas.

7.2 Local Synthetic Task Suite & Fixture Site

All evaluations execute against an offline, zero-network HTML fixture (tests/fixtures/eval_site.html) covering 12 canonical task categories:

  1. healthy_form: Multi-field input filling and submission.
  2. healthy_navigation: Tab/anchor view switching and URL hash updates.
  3. healthy_dropdown: Select option mutation and priority application.
  4. healthy_scroll: Container scrolling and revealed target interaction.
  5. healthy_input_validation: Client-side validation pattern matching.
  6. stuck_noop: Repeated clicks on inert elements triggering STATE_NOT_CHANGED.
  7. stuck_missing_locator: Non-existent element targeting triggering LOCATOR_NOT_FOUND.
  8. recovery_after_noop: Forced stuck loop requiring reasoning escalation and targeted DOM recovery.
  9. recovery_after_timeout: Stagnation recovery verifying closed-loop problem resolution.
  10. milestone_multi_step: 3-stage sequential milestone pipeline advancing MilestoneMonitor.
  11. readiness_blocked_element: Hidden/zero-pixel element targeting verifying SessionGuard timeouts.
  12. assertion_failure: Intentional negative test confirming the assertion engine flags failures safely without throwing unhandled exceptions.

7.3 Success Assertion Engine & Zero-Pixel Trap Prevention

Adapted from the ColdStart QA framework (coldstart/arc-cookbook/src/qa-framework/assertions.ts):

  • Checks element visibility (is_visible()).
  • Enforces positive bounding box dimensions ($w \ge \text{min_width}, h \ge \text{min_height}$) to catch flex-collapsed 0px elements (Zero-Pixel Trap).
  • Inspects computed styles (display !== 'none', visibility !== 'hidden', opacity > 0).
  • Strictly uses public Playwright APIs (page.locator(), loc.bounding_box(), page.url, page.title()), ensuring compliance with FORBIDDEN_PRIVATE_INTERNALS.

7.4 Cost Ledger Architecture

  • CostLedger: Quantifies execution economics across local Reflex steps (free/CPU-bound), Cortex reasoning tokens, and container infrastructure time.
  • Extensible Pricing Config: Provides default zero-cost profiles for Phase 4A mock execution while supporting future token-based pricing ($2.50/1M input, $10.00/1M output) and VM runtime ($0.018/hour) for Phase 4B/4C.

7.5 Reflex-Only vs Hybrid Comparative Protocol

The evaluation runner (EvalRunner) executes identical task sequences under two modes:

  • reflex_only: Fast local execution without monitors or Cortex fallback. Halts or fails when stuck loops or locator exceptions arise.
  • hybrid: Closed-loop orchestration. StuckMonitor and MilestoneMonitor govern execution; when anomalies occur, EscalationController triggers EvalCortexClient to synthesize recovery plans, execute recovery actions in the DOM, and resume execution.
  • Target Metric: Hybrid mode must achieve $\ge 90%$ success rate on solvable tasks and outperform Reflex-only by recovering from forced failures.

7.6 Future WebArena (Phase 4B) & OSWorld (Phase 4C) Integration Points

  • Phase 4B (WebArena): Will reuse EvalRunner, ScorecardBuilder, CostLedger, and evaluate_assertion while swapping eval_site.html with containerized WebArena task environments (Shopping, Reddit, GitLab, CMS).
  • Phase 4C (OSWorld): Will extend EvalAssertion with OS-level assertion checks (file system states, process inspection, AT-SPI accessibility queries) and run desktop tasks inside Arc MicroVMs.

8. Phase 4B: WebArena-Verified Subset Integration

Phase 4B connects the Arc evaluation harness to real-world web benchmark tasks through an integration layer for the WebArena-Verified benchmark, supporting Reddit (Postmill), Shopping (OneStopShop / Magento), and GitLab environments.

8.1 Architecture & Design

The Phase 4B architecture extends the evaluation pipeline with four modular components:

  1. WebArenaEnv (src/arc_cua/eval/webarena_env.py): Environment lifecycle controller managing live Docker containers and offline mock environments.
  2. DatabaseDiffEngine (src/arc_cua/eval/webarena_env.py): Dual-layer verification engine ported from coldstart/arc-cookbook/src/qa-framework/db-diff.ts to detect backend row-level insertions, updates, and deletions.
  3. webarena_mapper.py (src/arc_cua/eval/webarena_mapper.py): WebArena JSON/JSONL ingestion engine translating external benchmark schemas into EvalTask and EvalAssertion.
  4. WebArenaAssertionAdapter (src/arc_cua/eval/webarena_assertions.py): Domain assertion engine evaluating url_match, string_match, and program_html assertions against live or mock page and database states.
  5. WebArenaRunner (src/arc_cua/eval/webarena_runner.py): Integration runner orchestrating WebArenaEnv, EvalRunner, HybridRunner, and WebArenaAssertionAdapter.

8.2 Task Mapping Strategy

WebArena tasks are defined in JSON/JSONL format containing task_id, intent, start_url, sites, require_login, and an eval configuration block.

  • ID & Metadata: task_id maps to webarena_{task_id} with category set to sites[0] (e.g. reddit, shopping, gitlab).
  • URL Resolution: Placeholders such as __SHOPPING__, __REDDIT__, __GITLAB__, __WIKIPEDIA__, and __MAP__ are dynamically resolved by WebArenaEnv.resolve_url() against configured container ports or mock endpoints.
  • Assertion Mapping:
    • url_match $\to$ EvalAssertion(type="url_match", expected={"reference_url": ..., "url_note": ...}).
    • string_match $\to$ EvalAssertion(type="string_match", expected={"reference_answers": ..., "string_note": ...}).
    • program_html $\to$ EvalAssertion(type="program_html", expected=item).
  • Graceful Unsupported Handling: Evaluators for non-web modalities (e.g. image_match, manual, human_eval) are mapped to EvalAssertion(type="unsupported", expected="SKIP") and flagged in task metadata (supported: false), allowing evaluation suites to run without unhandled exceptions.

8.3 Assertion Adapter Logic

The WebArenaAssertionAdapter implements verification logic tailored to benchmark specs:

  • url_match: Normalizes schemes, hosts, paths, and trailing slashes. Supports exact URL equality, tolerant query parameter reordering (parse_qs), prefix matching (url_note="prefix"), and regex evaluation (re.compile).
  • string_match: Normalizes whitespace and casing. Supports fuzzy_match (case-insensitive substring inclusion), exact_match (full string equality), and must_include (conjunction of required tokens).
  • program_html:
    • point="db": Queries the domain SQLite database using env.query_db(sql) and asserts row counts, scalar values, or column subset dictionaries.
    • point="db_diff": Verifies state changes using DatabaseDiffReport (assert_inserted, assert_deleted, assert_unchanged).
    • point="dom": Evaluates DOM element visibility or state via public Playwright locator APIs.

8.4 Mock vs Live Environment Policy

To guarantee deterministic continuous integration without requiring local Docker infrastructure:

  • Offline Mock Mode (Default):
    • Operates completely offline without external network sockets or running Docker containers.
    • Backed by an in-memory SQLite database (:memory:) seeded with baseline schemas across Reddit (reddit_posts, reddit_comments), Shopping (shopping_orders, shopping_cart, shopping_products), and GitLab (gitlab_issues, gitlab_merge_requests).
    • Backed by MockWebArenaPage simulating interactive clicks, inputs, page state changes, and simulated backend database mutations.
    • Zero external network call guarantee strictly validated via socket-level interceptor tests.
  • Live Mode:
    • Activated by passing mode="live" or configuring environment variables (WEBARENA_SHOPPING_URL, WEBARENA_REDDIT_URL, WEBARENA_GITLAB_URL).
    • Pings live container reset endpoints between tasks and attaches to real headless Chromium sessions.

8.5 Representative Subset Selection

A curated suite of 12 tasks (src/arc_cua/eval/tasks_webarena.py) represents the core WebArena benchmarks across 3 domains:

  1. Reddit: Subreddit thread browsing (url_match + string_match), comment submission (program_html), user profile inspection (url_match + string_match), and post submission (program_html).
  2. Shopping: Catalog search (url_match + string_match), cart addition (program_html), cart view review (url_match + string_match), and checkout order placement (program_html + url_match).
  3. GitLab: Issue lookup (url_match + string_match), issue creation (program_html), merge request listing (url_match + string_match), and merge request creation (program_html).

9. Phase 4C: OSWorld Desktop Subset Integration

Phase 4C connects the Arc evaluation harness to real-world desktop benchmark tasks through an integration layer for the OSWorld benchmark (Xie et al., 2024), supporting operating system file management, terminal command execution, and desktop application accessibility (Visual Studio Code, GNOME Terminal, LibreOffice).

9.1 Architecture & Design

The Phase 4C architecture introduces five modular components to evaluate desktop tasks:

  1. OSWorldEnv (src/arc_cua/eval/osworld_env.py): Desktop environment lifecycle controller managing file operations, terminal command execution and history, and AT-SPI accessibility state across both offline mock testbeds and live Linux desktop environments.
  2. osworld_mapper.py (src/arc_cua/eval/osworld_mapper.py): OSWorld JSON/JSONL ingestion engine translating external benchmark tasks into internal EvalTask and EvalAssertion contracts.
  3. OSWorldAssertionAdapter (src/arc_cua/eval/osworld_assertions.py): Desktop assertion adapter evaluating file_exist, file_content_match, terminal_output_match, and at_spi_state_match assertions against environment state.
  4. tasks_osworld.py (src/arc_cua/eval/tasks_osworld.py): Curated subset suite of 12 representative desktop tasks across os_fs, terminal, and desktop domains.
  5. OSWorldRunner (src/arc_cua/eval/osworld_runner.py): End-to-end integration runner coordinating OSWorldEnv, MockOSWorldPage, HybridRunner, and OSWorldAssertionAdapter.

9.2 Task Mapping Strategy

OSWorld tasks are defined in JSON/JSONL format containing id or task_id, instruction, domain / category, start_state (initial files, terminal commands, AT-SPI hierarchy), and an eval configuration block:

  • ID & Category: Mapped to EvalTask.task_id and EvalTask.category (e.g. os_fs, terminal, desktop).
  • Start State: Initial files and terminal history are retained in EvalTask.metadata["start_state"] and restored by OSWorldEnv.reset() prior to execution.
  • Assertion Mapping:
    • file_exist $\to$ EvalAssertion(type="file_exist", selector=file_path, expected=bool).
    • file_content_match $\to$ EvalAssertion(type="file_content_match", selector=file_path, expected={"pattern": ..., "match_type": ...}).
    • terminal_output_match $\to$ EvalAssertion(type="terminal_output_match", expected={"pattern": ..., "match_type": ...}).
    • at_spi_state_match $\to$ EvalAssertion(type="at_spi_state_match", selector="app:role:name", expected={"app_name": ..., "role": ..., "name": ..., "state": ..., "expected": bool}).
  • Graceful Unsupported Handling: Evaluators requiring external VLM scoring, manual inspection, or visual layout diffing (e.g. image_similarity, vlm_score, audio_diff) are mapped to EvalAssertion(type="skip") and handled gracefully without unhandled exceptions.

9.3 Assertion Adapter Logic

The OSWorldAssertionAdapter implements evaluation logic verifying desktop states:

  • file_exist: Inspects file presence in OSWorldEnv via file_exists(path). Supports positive checks (expected=True) and file removal/cleanup checks (expected=False).
  • file_content_match: Reads file content via read_file(path) and supports:
    • substring: Case-preserving substring inclusion.
    • exact: Whitespace-stripped exact equality.
    • regex: Multi-line regular expression matching (re.search).
    • lines_include: Multiline set inclusion checking that all expected lines are present.
  • terminal_output_match: Compares patterns against get_terminal_output() and get_terminal_history():
    • substring & exact: Validates output text buffers.
    • regex: Multi-line regular expression matching.
    • command: Validates command strings in terminal command execution history.
  • at_spi_state_match: Queries OSWorldEnv.get_desktop_tree() and OSWorldEnv.find_nodes() to locate accessible widgets matching application name (code, gnome-terminal), semantic role (push_button, terminal, entry, page_tab), accessible name, and state flags (showing, visible, enabled, focused, selected).

9.4 Mock vs Live Desktop Environment Policy

To maintain zero-dependency local testability and fast CI feedback without spinning up full Linux VM / QEMU containers:

  • Offline Mock Mode (Default):
    • Operates completely offline with zero network socket connections or VM hypervisors.
    • Backed by an in-memory POSIX-normalized file system (_mock_fs).
    • Backed by a simulated command-line interpreter supporting basic POSIX shell patterns (echo, cat, touch, rm, git, gcc, grep, redirection >).
    • Backed by AT_SPI_Bridge(mode="mock") providing representative GTK (GNOME Terminal), Electron (VS Code), and Qt desktop hierarchies.
    • Interactive actions are dispatched via MockOSWorldPage to execute file and terminal mutations.
  • Live Mode:
    • Activated by passing mode="live" or setting OSWorldEnv(mode="auto") when running in a live Linux desktop (X11/Xvfb with DISPLAY and D-Bus session with AT_SPI_BUS_ADDRESS).
    • Operates against the host filesystem using pathlib.Path.
    • Executes live commands via subprocess.run.
    • Attaches directly to Linux D-Bus org.a11y.Bus for sub-2.0ms accessibility tree serialization.

9.5 Representative Desktop Subset Selection

A curated suite of 12 tasks (src/arc_cua/eval/tasks_osworld.py) covers 3 primary desktop domains:

  1. os_fs (Tasks 201-204): Summary file generation (file_exist + file_content_match), diagnostic log archiving (file_exist), temporary artifact deletion (file_exist negative), and version configuration updates (file_content_match).
  2. terminal (Tasks 205-208): System diagnostic execution (terminal_output_match), git repository staging and committing (terminal_output_match), error log grepping (terminal_output_match), and native library compilation via gcc (terminal_output_match).
  3. desktop (Tasks 209-212): Visual Studio Code benchmark execution button inspection (at_spi_state_match), VS Code quick open file search input accessibility (at_spi_state_match), GNOME Terminal tab switching (at_spi_state_match), and GNOME Terminal VTE screen focus (at_spi_state_match).

10. Phase 5: Live Production Integration & Final Scorecard

10.1 Architecture & Design

Phase 5 bridges the gap between offline mock CI testbeds and production cloud infrastructure:

  1. ArcCloudDriver (src/arc_cua/cloud/arc_driver.py):
    • Connects to the Arc Cloud REST API to provision ephemeral MicroVMs, stealth browsers, and desktop sandboxes.
    • Supports environment configurations: ARC_API_KEY, ARC_REGION, ARC_API_URL.
    • Implements methods: provision_browser(), provision_desktop(), get_cdp_endpoint(), get_vnc_stream(), get_replay_url(), and terminate().
    • Provides zero-crash graceful fallback to local mock mode if ARC_API_KEY is not detected.
    • Accurately tracks compute duration in milliseconds per session for infrastructure cost accounting.
  2. RealLlmCortex (src/arc_cua/cortex/real_llm_cortex.py):
    • Connects the Cortex reasoning engine to real frontier and System-1 models (TypeSafe Jev, OpenAI GPT-4o, Anthropic Claude).
    • Enforces strict safety gate: refuses instantiation unless CORTEX_MODE=real.
    • Formats EscalationPayload into a deterministic system/user prompt enforcing JSON RecoveryPlan output.
    • Parses LLM output (stripping markdown fences) and compiles through RecoveryCompiler to validate action safety.
    • Tracks exact input and output tokens and computes dollar costs via provider pricing tables.
    • Implements exponential backoff retries with circuit breaker timeouts.
  3. LiveOrchestrator (src/arc_cua/eval/live_orchestrator.py):
    • Inspects host virtualization and containerization capabilities (Docker daemon, Docker Compose, Linux KVM /dev/kvm, QEMU, SSH).
    • Manages WebArena docker-compose lifecycle: start, stop, DB wipe/reset.
    • Manages OSWorld QEMU/KVM VM lifecycle: spawn, SSH/VNC health check, COW snapshot restoration.
    • Implements wait_for_healthy() with robust socket and HTTP polling.
    • Implements reset_state() to wipe databases and restore VM snapshots between benchmark tasks.
    • If live infrastructure is unavailable, logs LIVE_ORCHESTRATION_SKIPPED and exits gracefully without raising exceptions.
  4. Production Scorecard Generator (scripts/reports/report_production.py):
    • Executes representative subsets across WebArena and OSWorld benchmarks.
    • Computes real total cost: Arc MicroVM compute + Real LLM tokens + Stealth proxy and session replay storage.
    • Computes real wall-clock latency percentiles ($p_{50}, p_{95}, p_{99}$) and Step Efficiency Ratio ($\text{SER} = \text{Agent Steps} / \text{Human Gold Steps}$).
    • Outputs production artifacts to artifacts/production/: final_scorecard.json, production_report.md, and live_trajectory_logs.jsonl.

10.2 Production Deployment Guide

To run ARC in live production environments:

# 1. Configure Cloud & LLM Credentials

11. Phase 6: Full-Scale Benchmarking, Model Training & Final Reporting

11.1 Architecture & Design

Phase 6 transitions the ARC system from an offline architectural prototype into a full-scale research and deployment platform:

  1. Full WebArena Benchmark Runner (scripts/benchmarks/run_full_webarena.py):

    • Ingests and executes the entire 812-task WebArena dataset.
    • Supports chunked execution (--chunk-size 50, --chunk-index N) for distributed or batched evaluation.
    • Implements persistent resumption by reading completed task IDs from webarena_results.jsonl.
    • Probes live Docker containerization via LiveOrchestrator; if live infrastructure is missing, executes the first 20 tasks in offline mock mode to verify harness integrity, then records FULL_RUN_REQUIRES_LIVE_INFRA.
  2. Full OSWorld Benchmark Runner (scripts/benchmarks/run_full_osworld.py):

    • Ingests and executes the entire 369-task OSWorld desktop dataset.
    • Supports chunking and persistent resumption via osworld_results.jsonl.
    • Captures file-system diffs (added, removed, modified files) and AT-SPI accessibility state (active window, focused widget, total node count) before and after each task execution.
    • Probes live KVM and X11 display availability; if missing, executes first 20 tasks in mock mode and records FULL_RUN_REQUIRES_LIVE_INFRA.
  3. ModernBERT Monitor Training Pipeline (src/arc_cua/monitors/training_pipeline.py & scripts/training/train_monitors_full.py):

    • Collects all trajectory logs across all phases and windows them into contextual state representations.
    • Uses AutoLabeler to generate deterministic stuck and milestone labels.
    • Implements an 80/20 train/test split, inverse frequency class balancing (stuck and milestone events are rare), and F1-score validation early stopping.
    • Enforces strict safety gate: if PyTorch, HuggingFace Transformers, or CUDA GPUs are unavailable, immediately writes artifacts/phase6/models/TRAINING_SKIPPED.md and exits cleanly without crashing.
  4. Final Research & Pitch Report Generator (scripts/reports/generate_final_report.py):

    • Integrates artifacts/production/final_scorecard.json, webarena_results.jsonl, and osworld_results.jsonl.
    • Automatically compiles artifacts/phase6/FINAL_RESEARCH_REPORT.md featuring Executive Summary, Architecture Overview, Benchmark Comparisons, Pareto Cost/Latency Frontiers, Monitor Efficacy, and Conclusion.
    • Clearly labels mock evaluation runs as PROJECTED_BASED_ON_MOCK_EXECUTION.
